Transformer Training Dynamics Analysis

Two papers landed on ArXiv on March 20th, and together they sketch an unusually coherent picture of what is actually happening inside a transformer during training — not the loss curves we monitor, but the underlying geometric structure of the process itself. The first, on spectral edge dynamics, examines how signal and noise separate across scales as training progresses, treating the weight matrices as evolving spectral objects rather than just collections of numbers. The second paper takes a different but complementary angle: it argues that optimizers like Adam are not steering through a high-dimensional space uniformly, but are instead inducing a kind of low-dimensional drift — a preferred direction of travel — while the transverse directions, orthogonal to that drift, behave quite differently. Read together, these aren't two isolated curiosities. They're two researchers, apparently independently, pointing at the same underlying phenomenon: transformer training is far more structured, far more geometrically constrained, than the standard narrative of gradient descent through a chaotic loss landscape suggests.

If confirmed, here is what this means. The implication is that we have been flying somewhat blind — optimizing transformers with tools calibrated to a picture of training that may be fundamentally incomplete. If training genuinely proceeds along low-dimensional manifolds with predictable spectral signatures, then the design space for better optimizers opens up dramatically. You could, in principle, build optimizers that explicitly exploit the geometry rather than stumble across it. More pressingly, it would reframe interpretability research: if the meaningful directions of change during training are geometrically identifiable, we gain a new lens on how capabilities actually emerge. For anyone investing in compute at scale, it raises a pointed question about whether current training runs are navigating efficiently or simply burning budget on transverse noise.

Watch for follow-up work that applies these geometric frameworks to training runs at scale — billion-parameter models rather than the smaller regimes where this kind of analysis is tractable. Empirical validation from an industrial lab would change the significance of this story considerably.
